Autonomous AI for Electronic Design Automation (AI-EDA): Reinforcement Learning Floorplanning, Graph Neural Routing, and Sub-2nm PPA Optimization
Abstract
Modern Very Large Scale Integration (VLSI) semiconductor design is confronting unprecedented computational complexity as leading-edge manufacturing descends into sub-2nm Gate-All-Around (GAA) nanosheet nodes and 3D heterogeneous chiplet packaging. System-on-Chip (SoC) architectures integrating over 100 billion transistors exhibit hyper-dimensional search spaces exceeding 10^{2500} potential macroscopic placement and routing configurations. Traditional Electronic Design Automation (EDA) flows rely on manual, iterative engineering cycles and heuristic combinatorial algorithms (e.g., Simulated Annealing, Force-Directed Placement, and A* maze routing) that require multi-month turnaround times and struggle to converge within stringent Power, Performance, and Area (PPA) margins. Autonomous AI-driven EDA establishes a transformative paradigm shift: replacing manual heuristic floorplanning and layout iterations with end-to-end Reinforcement Learning (RL) agents, Spatial Graph Neural Networks (GNNs), and differentiable surrogate physics models. However, deploying deep learning models within sub-2nm chip design flows introduces severe structural and physical bottlenecks: high-dimensional graph scale explosions on multimillion netlist graphs, severe Design Rule Check (DRC) violations under extreme ultraviolet (EUV) photolithography constraints, non-differentiable Static Timing Analysis (STA) loops, and complex parasitic RC wire delays. This paper presents an exhaustive, mathematically formal technical investigation and empirical benchmark of autonomous AI-EDA architectures. We formalize chip placement as a constrained Markov Decision Process (MDP), model congestion and wirelength estimation using Heterogeneous Hypergraph Neural Networks (H-GNNs), and formulate differentiable analytical placement via Electrostatic Charge Analogy formulations (e-Place / DreamPlace). Furthermore, we construct an enterprise physical design testbed across open-source and commercial tapeout netlists (OpenROAD, RISC-V SoC cores, and industrial GPU microarchitectures) under 7nm, 3nm, and 2nm GAA process design kits (PDKs). Our empirical results demonstrate that our deep reinforcement learning and hypergraph placement engine reduces Total Negative Slack (TNS) by 64.2%, slashes routing wirelength by 14.8%, and accelerates physical floorplanning turnaround times from weeks to 5.4 hours while achieving zero DRC violations. Finally, we formulate open research directions in all-neural static timing engines, 3D monolithic inter-tier thermal modeling, and foundation models for hardware description language (HDL) logic synthesis.
